What Is the Bias-Variance Tradeoff and Why Marketers Should Care

Every statistical model lives on a continuum between bias and variance, and navigating that tradeoff is one of the most critical modeling decisions you’ll ever make. Let’s start by getting clear on each term:

Bias is the average error a model makes when fitting historical data. A high-bias model is too simple – it will underfit, miss patterns, and oversimplify dynamics that do matter. Think of a model that collapses all your observations to a single average: low variance, but consistently wrong.

Variance, by contrast, is the additional error that shows up when a model is applied to unseen data. A high-variance model is overly sensitive to fluctuations in the training data. It fits the past extremely well – sometimes with zero in-sample error – but will perform poorly on future data because all that it has captured is noise.

So this is the bias-variance tradeoff. As model complexity increases, bias declines… but variance rises. Initially, that tradeoff is favorable: you reduce bias faster than variance increases. But at some point, the variance gets too high and starts to dominate. Each new parameter you add brings more volatility than insight, and your total error (on held-out data) goes up.

The relationship between complexity and total out-of-sample error follows a U-shaped curve. On the left: underfit models with high bias. On the right: overfit models with high variance. The optimal model complexity sits at the bottom of that curve – in the Goldilocks Zone – where the model is just flexible enough to capture real patterns but doesn’t just give you noise.

Seems simple enough, but the challenge is that you don’t get to see this curve directly. 

In real-world scenarios, especially in marketing mix modeling, your data is limited, autocorrelated, and has plenty of confounders. So if you’re not explicitly testing for where your model sits on this curve (we will share how we do it in this article), there’s a real risk you’re operating with a model that looks good in-sample but fails the moment it’s asked to forecast.

How Does Bias–Variance Show Up in Marketing

The underlying challenge behind the bias-variance tradeoff is that MMM models already have to handle a lot – a lot! – of complexity. You’re estimating daily ROI and saturation effects for multiple channels, delayed response curves, organic trends, seasonality, and an endless list of potential variables. 

The temptation is to make the model more complex to better “fit” the past – but that often makes it worse at predicting the future. 

You’ll know high-variance when you see it: the model tells you to scale spend on a “top-performing” channel, but you miss revenue targets by 30%. Or when you run a flash sale for a holiday and it throws off your entire channel curve. Or when you get drastic changes in ROI week to week without any meaningful changes in your strategy. Or when leadership asks why a channel went from crushing it to zero overnight, and no one has a good answer.

Maybe the easiest way of catching this is when small changes in data cause large swings in model output. If replacing just 14 days of data across a multi-year dataset changes your top-performing channel, how could you ever forecast confidently?

These are all symptoms of high-variance modeling. Let’s now go through what you can do about it.

How Recast Navigates the Tradeoff

You can’t escape the bias–variance tradeoff, but you can try and land in the optimal place within it.

At Recast, this starts with regularization, which limits how freely the model can “contort” itself to match noise. Even if the full model has hundreds of parameters, regularization makes sure that only the ones with a real signal carry weight. This reduces the effective complexity of the model and helps to avoid overfitting.

But we also need to test how well the model generalizes. We systematically hold out 30, 60, or 90 days of data and then test how well the model predicts those missing periods. If the model fits the past but fails to predict the future, we dial back complexity until it recalibrates.

The third layer is what we call the Stability Loop Check. Every week, as new data becomes available, our models update by removing the oldest 7 days and adding the newest 7. That’s a small change across a dataset that spans years. It shouldn’t cause major swings. So if model outputs shift dramatically – if we see a channel’s ROI doubling or collapsing – we know the model is unstable and variance is too high.

Together, these checks create a real-world feedback loop that puts it under pressure and checks if it’s stable or if it’s just noise. 

What Marketing Leaders Should Ask MMM Vendors

If you’re a non-technical marketer, we know that you won’t tune the model yourself – but you do need to ask the right questions about how that model behaves.

The first question: how does the model handle new data? If a vendor can’t explain what happens when you hold out 60 days and test forecast accuracy, that’s a problem. The ability to predict unseen data is the whole point.

Next, ask: how often do results change, and how big are the changes? If ROI estimates or channel rankings are constantly flipping dramatically without major media changes, the model likely has high variance.

And finally: what kind of robustness checks are in place? Ask about holdout testing. Ask whether the model behaves stably when updated with new data. You’re looking for detailed answers to specific tests they’re running.

Again, there’s no “solving” the bias–variance tradeoff. Every model sits somewhere on the curve, whether you acknowledge it or not. The key is knowing where your model stands and consistently pressure-testing it.
